Understanding Physiological Time Series Challenges

Medical time series data, such as ECG and EEG, are critical for diagnostics but pose unique challenges due to their multivariate nature, high temporal variability, noise, and artifacts. Traditional deep learning methods struggle with data incompleteness and inconsistent performance across different channels and patient samples, highlighting a significant need for more robust reconstruction and imputation techniques.

Diffusion Models in Time Series

Score-based diffusion models have emerged as state-of-the-art for general time series tasks like reconstruction, imputation, and forecasting, demonstrating impressive capabilities in modeling complex data distributions. However, their application specifically to physiological time series data remains largely underexplored, despite the unique characteristics of these signals that could greatly benefit from advanced generative modeling.

Leveraging Mixture of Experts for Adaptivity

Mixture of Experts (MoE) models have shown remarkable success in computer vision and natural language processing by enabling specialized expert models to extract distinct features and adapt dynamically to input data. Our work innovatively applies MoE to physiological signals, addressing the challenge of inconsistent periodicity and channel-specific characteristics by deploying a Receptive Field Adaptive MoE (RFAMoE) block.

Our Novel MoE-based Diffusion Framework

We propose a conditional Diffusion-based MoE framework featuring a RFAMoE module, allowing each channel to adaptively select optimal receptive fields. A key innovation is the Fusion MoE module, which generates K noise signals in parallel and fuses them into a single inference step. This not only enhances reconstruction accuracy over multi-inference averaging but also drastically reduces computational cost and latency, making it practical for real-world medical applications.

Superior Performance Across Tasks and Datasets

Extensive experiments on PTB-XL (ECG) and SleepEDF (PSG) datasets demonstrate our method's consistent outperformance against SOTA diffusion models for reconstruction and imputation. We achieve significantly lower PRD, SSD, and MAD errors, and dramatically reduce computational burden (FLOPs and inference time) compared to K-shot averaging, validating its robustness and efficiency for complex physiological signals.

Figure 1 highlights that traditional single DNN models struggle with the high variability and distinct characteristics of physiological time series, leading to inconsistent reconstruction quality across channels and samples. Our MoE-based approach directly addresses this by allowing specialized experts.

7.21 PRD Achieved by Our Method

Our method significantly outperforms SOTA diffusion models in physiological time series reconstruction, achieving a PRD of 7.21 on the PTB dataset, demonstrating superior reconstruction accuracy.

91% Fewer FLOPs Compared to 12-shot Averaging

The Fusion MoE module generates K noise signals in parallel and fuses them in a single inference step, drastically reducing computational overhead. This leads to 91% fewer FLOPs compared to 12-shot K-shot averaging while improving performance.
